How do you implement privacy-preserving machine learning?
Privacy-preserving ML enables model training and inference on sensitive data without exposing individual records. Techniques: (1) Federated Learning: train models across distributed devices or organizations without centralizing data. Each participant trains locally on their data, sends model updates (gradients) to a coordinator, coordinator aggregates updates into a global model, and the global model is distributed back. No raw data leaves its origin. Used by Google (Gboard prediction), Apple (Siri improvement), and healthcare consortia. (2) Differential Privacy: add calibrated noise to training data or model outputs to limit what can be inferred about any individual. Privacy budget (epsilon) quantifies the privacy guarantee. Smaller epsilon means stronger privacy but lower model accuracy. Implement using libraries like Opacus (PyTorch), TensorFlow Privacy, or Google's differential privacy library. (3) Secure Multi-Party Computation (SMPC): multiple parties jointly compute a function over their combined inputs while keeping each party's input private. Enables training on combined datasets without sharing raw data. Computationally expensive but provides strong cryptographic guarantees. (4) Homomorphic Encryption: perform computations on encrypted data without decrypting. Model inference can run on encrypted inputs and produce encrypted outputs. Practical for simple models; still too slow for deep learning training. (5) Synthetic Data Generation: train a generative model on sensitive data, then use the generative model to produce synthetic data that preserves statistical properties without containing real records. Validate that synthetic data does not memorize individual training examples. Implementation considerations: choose technique based on threat model (who are you protecting data from), accuracy requirements (stronger privacy reduces accuracy), computational budget (SMPC and HE are expensive), and regulatory requirements (GDPR, HIPAA). Often combine techniques: federated learning with differential privacy provides both data locality and mathematical privacy guarantees.
