How do you implement secure AI model deployment and MLOps security?
Secure MLOps protects the entire ML lifecycle from data acquisition through model serving. Supply chain security: verify training data provenance and integrity, scan dependencies for vulnerabilities (ML libraries, CUDA versions, container base images), sign model artifacts with cryptographic signatures, and maintain SBOM (Software Bill of Materials) for ML pipelines. Model storage: encrypt model files at rest, implement access control on model registry (who can publish, who can deploy, who can download), version all models with immutable artifacts, and implement model scanning for embedded malicious code. Deployment security: deploy models in isolated containers with minimal permissions, implement network segmentation (model serving endpoints on a private network, accessible only through API gateway), use read-only file systems in serving containers, and restrict model containers from making outbound network calls. API security: implement authentication and authorization for model endpoints, rate limiting to prevent model extraction, input validation to reject malformed requests, and output filtering to prevent information leakage. Runtime monitoring: detect model behavior anomalies (sudden accuracy drops may indicate adversarial attacks or data poisoning), monitor for unusual query patterns (extraction attempts often show systematic input variation), track model latency and resource usage (cryptomining can hide in ML infrastructure), and implement drift detection as a security signal. Secrets management: store API keys, database credentials, and encryption keys in a vault (never in model code or configuration), use short-lived credentials for pipeline execution, and rotate secrets on a schedule. Compliance: log all model predictions for audit trails (especially for regulated industries), implement model versioning for reproducibility, and maintain documentation for regulatory review. Incident response: maintain playbooks for model compromise scenarios, implement kill switches for immediate model disabling, and have rollback procedures for reverting to previous model versions.
